Under the environment, the original public opinion methods and its decision support module became insufficient for the application requirements. New public opinion analysis methods needs to be able to analyze not only all critical financial market information but also massive user-generated content, including blogs, tweets and posts. More importantly, FDSSs need to extend its knowledge base to new public opinion analysis so as to provide more valuable evidence for decision making. The aims of this study is to theoretically investigate the feasibility of adopting public opinion knowledge, provided by public opinion analysis, in the financial decision support domain, and to propose a general design of such knowledge enhanced FDSS.2.Introduction2.1.Research questionIn big data era, people are facing much more challenging and complicated decision making problems than before. These problems involve information from various aspects of financial market. To help financial professionals make better decisions, effective financialdecision support systems always incorporate the analysis of many kinds of market information, from market activity and movement data, company internal managerial information to latest financial news for a particular market or company.There were many researches on adopting various natural language processing techniques to the examination on market information such as financial news (Schumaker and Chen, 2009), annual reports (Li, 2006) and online discussion board (Das and Chen, 2007), in use of predicting market movement or stock price movement. One of the most popular topic is the application of text mining techniques on textual financial information to predict the performance of individual stock or the movement of the market. At a macro economy level, Peramunetilleke et al. used news headlines to predict currency exchange rates (Peramunetilleke and Wong, 2002). On a company level, Smailovic et al. examined tweets to predict stock price changes (Smailovic et al., 2012). There were also many specific application research of using test mining techniques like sentiment analysis to examine financial information. Ruiz-Martinez et al. proposed a semantic-based sentiment analysis algorithm to conduct semantic sentiment analysis on financial news, by assigning different degrees of positivity or negativity to annotated terms, to calculate the polarity of the news (Ruiz-Martinez, Valencia-García and Garcia-Sanchez, 2012). But in web environment, these partial application of natural language processing techniques on one or few sources of financial information is no longer efficient and accurate enough for financial decision making.An important characteristic of Web is the social web. Users interact with other users or applications to share their perspectives, opinions and thoughts. They are no longer a user of the application or website but also a participant of the social web. The growth of user-generatedcontent is exponential. Web content is no longer discrete but with strong interactive relationship. Although many different applications of natural language processing in financial information analysis systems yield positive results, they mainly rely on the text mining techniques to analyze financial information linguistically, calculate polarity and sentiment scores. Its limitation become more obvious in analyzing huge amount of interconnected Web content.,One of the most comprehensive methods to examine financial related information under Web environment is conducting public opinion analysis with various information source. Big data public opinion analysis is in the forefront of big data and public opinion analysis research. It use test mining and big data process related techniques to extract useful knowledge from mass data in support of decision making. It is critical for financial professions or senior management of company to gather comprehensive public opinion knowledge on related subjects as well as summarization and insights on financial market information.Nowadays, decision support modules are always embedded in public opinion analysis systems, to give decision support evidence through visual presentation. If public opinion analysis system can construct an expert knowledge base which can be further incorporated in financial decision support system to give out intellectual strategy suggestion, it would improve the efficiency and accuracy of financial decision making process. Yet there was no systematic research study on this area.Driven by the motivation to make up this research gap, my proposed research questions listed as follows:1.Whether it is feasible for big data public opinion analysis systemto construct public opinion knowledge base2.Whether it is feasible to incorporate the public opinion knowledgein the market information analysis process3.Whether the public opinion knowledge enhanced FDSSs can provide moreuseful and accurate evidence to support financial decision making 4.If the answers of the first three question are yes, then what isthe general design for the public opinion knowledge enhanced financial decision support systemReferring to the previous studies on big data public opinion analysis and decision support system (Cheng et al., 2010; 陈 and 曹, 2013; Cao et al., 2014), I believe it is feasible to construct expert public opinion knowledge base and apply it to financial decision support system with a hierarchical model. As a design science research, this study will aim to propose a general design for the public opinion knowledge base enhanced FDSS as a general system design guidance.2.2.Research methodologiesMethodology is the systematic, theoretical research strategy that comprises the rationale of the research, paradigm, theoretical model, phases and quantitative or qualitative techniques and the criteria used to interpreting data and reach the conclusion (Bailey, 1978; Irny and Rose, 2005). The paradigm of design science of information system require researchers to understand the important existing problems, explore its theoretical insights and offer solutions through building and evaluating innovative IT artifacts (Hevner, Match et al. 2004). As a design science research, this study will follow the paradigm with the final purpose of building a feasible prototype of public opinionknowledge enhanced FDSS.¥Given the questions proposed in previous section, this study will follow the framework of design science to solve them. Firstly, a thorough theoretical investigation will be conducted to examine the feasibility and effectiveness of such knowledge enhanced FDSS. From existing literatures, I will compare a variety of big data processing related techniques that has been used in public opinion analysis and evaluate their feasibility and efficiency when applied to construct knowledge base for the use of financial decision support. Related big data analysis techniques fall into following categories: data collecting techniques, internet public opinion topic detection and tracking (TDT), hotspot evaluation and analyzing and processing. Most effective and efficient big data processing techniques will be chosen, combined with behavior analysis methods, to build proposed FDSS. [Selection criteria]Secondly, dealing with the fourth question, this study will propose a general design for public opinion knowledge enhanced FDSS. The general design of such FDSS will follow the framework proposed by Walls et al. (Wall, 2004), which includes meta-requirements, meta-design and kernel theories. The meta-requirements describe what goals the theory will be applied for. It is preliminarily set as followings: the need to analyze the market information, including user-generated content, the need to incorporate public opinion knowledge and the need to effectively and efficiently support financial decision making. Meta-design describe the hypothesized system designed to meet meta-requirements. Kernel theories refer to design theories supported by justificatory knowledge from the natural or social or design science (Walls, Widemeyer, and ElSawy, 1992). The general design will include the design of conceptual model, the design of system architecture the design of reasoning model and hierarchical model integration.In the end, a prototype system will be developed based on general design to test the feasibility, effectiveness and efficiency. We will follow the methodology, and propose a general design for public opinion knowledge enhanced FDSS. To test its effectiveness and efficiency, a group of hypotheses will be given out and examined by a series of experiments. For example, we can set Hong Kong as the target market and let the system conduct public opinion analysis with information from various local or global sources on specific domain. System will generate a suggest strategy on such subject. To compare the results yielded from suggested strategy and the actual situation would prove the system is effective and efficient or not.3.Literature Review3.1.Public opinion and financial decision supportPublic opinion was first introduced back in seventeenth century by John Locke, whose work contains an early consideration of the importance of public opinion in the ordering of politics. From existing studies, we can divided social public opinion into three eras: traditional social public opinion analysis, internet public opinion analysis and big data public opinion analysis. Traditional social public opinion analysis tends to analyze the influence of hot social issues, policies and new legal provisions on social crowds (Bachner and Hill, 2014). MacLennan et al. (2012) studied New Zealand people’s attitudes to alcohol policies by the way of sampling survey. The rise of new social media platform set off the fever of internet public opinion analysis. Ceronet al. (2013) correctly predicted the president election of France in 2012 by using online public opinion data collected from Twitter, which proved that social media had a potential predictive ability.Big data public opinion analysis is one of the forefront research topic of public opinion analysis. It mainly use data mining and big data related technique to extract useful knowledge from massive amount of data for decision support (Power, 2002; Chen, Chiang and Storey, 2012). Exiting literature is more focused on big data public opinion related opportunities, challenges and research methods. There are less studies on big data public opinion from technical aspect. Broniatowski, Paul and Dredze (2014),Li Biao (2013) and Li Xiguang (2014) narrated existing problems of big data public opinion analysis from a theoretical angle and gave detail description of public opinion information collection, study and judge and early warning functions under big data surroundings. Yu (2013) conducted public opinion analysis on China society by adopting big data analysis techniques on Baidu keywords. Merman and Scharkow (2013), Ji (2012) et al. detailed studied big data processing techniques such as parallel processing, cloud computing, advance machine learning and intellectual data processing. Li Jinhai (2014) proposed a text mining model for internet public opinion analysis using big data theory, whose accuracy and timeliness was proved through tests.As for the decision support aspect, tradition decision support modules are based on model libraries, giving visual presentation to decision makers by calling module functions. For internet public opinion analysis, there were already many commercialized systems, such as Twelvefold, Buzz Metrics, Reputation Defender. Similar Chinese products including 乐思, 云鸽, 人大方正and 优讯. There was no complete system of researching methods on big data public opinionanalysis. Most of existing studies are combining bid data characteristic related analysis techniques with methods inherited from internet public opinion analysis phrase (李, 何 and 熊, 2014; Sun, Ye and Ren, 2014).With the rapid development of internet application to financial domains, the usage of public opinion analysis is now no longer limited to pure social science field. Along with big data trend, it has now stepped into financial investment field, which are more professional and the need of accuracy, effectiveness and timeliness are much urgent more than ever. Public opinion can affect real financial market, institutions even macroeconomic through certain mechanism (Hester and Gibson, 2003). In order to protect and maintain proper order for financial market, financial regulatory agencies need to adopt financial public opinion based financial regulatory measures. Investors and financial agencies can also utilize public opinion analysis on financial market or certain hot issues about certain company or domain to predict future movement on that subject. With the development of internet and big data trend, the influence of internet financial information especially public opinion on financial market attracts more and more attention (Kiousis, Popescu and Mitrook, 2007).3.2.Decision support model for public opinion analysis in bigdata environmentThere are few studies regarding social public opinion based decision support system. In existing literature, decision support module is always located at the service layer of public opinion monitoring system, providing evidence for decision making via visual presentation (Cheng et al., 2010; Cao et al., 2014). Currently, the main functions of decision support module of public opinion monitoring system includinganalyzing public opinion information using preset models, detect and track public opinion topics and its development, automatically summarizing statistic information and decision support, etc. For existing public opinion monitoring systems, the final response strategies are always made by professional analysts, lacking intellectual strategy recommendation system. For example, the models proposed by Feng Cao (2014) and Ding and Xu (2009), which can be seen as decision support systems extracted from decision support module from public opinion monitoring system, still cannot automatically generate response strategy.)Based on studies of Feng Cao (2014), Cheng (2010) and Chen (2013), Xia and Zhen (2015) proposed a preliminary hierarchical model for public opinion analysis and decision support system (Figure 1). This modelFigure 1has three modules: data collection and storage, data processing and decision support. It added big data processing and storing technologies to existing public opinion analysis system, and most importantly, added expert knowledge base to decision support module. By adopting big data processing techniques and expert knowledge bases, this model will be able to give out recommendation strategies other than passively providing decision support evidences. Xia and Zhen’s proposed model separated decision support function from public opinion analysis system to be an individual module, and added big data technologies and expert knowledge base into the consideration. Though there is still a gap between this model and ideal design of such model applied in financial domain, this model may exerts great influence and help to this study.4.Objective and Value4.1.Research objectiveProposed detailed objectives are listed as follows:1.To conduct theoretical investigation of the feasibility of publicopinion knowledge enhanced FDSS. The scope will include but not limited to previous studies review, evaluation on technical feasibility, effectiveness and efficiency and conceptual model feasibility.2.To develop a general design for public opinion knowledge enhancedFDSS.3.To develop prototype system including a conceptual model andframework, which should be able to be embed into a domain used for specified financial decision making process.4.To demonstrate the usage of proposed prototype system and itsconceptual model and framework in specific domains. It is crucial for companies or financial regulatory intuitions to monitor public opinions on related subjects to manage negative risk events outbreak which may damage their reputation or business. 因此,传统的文本语义分析技术在社交媒体文本上的直接应用取得的效果并不理想。
针对推文中语义信息量和准确度有限的特点,本文在现有的文本语义分析技术的基础上,研究了一种语义和情感信息结合的推文特征学习方法,并将该推文特征应用于推特事件检测。
本文的主要工作可概括为以下两个部分:1. 构建语义和情感结合的词语表示。
词语的语义向量是文本语义分析的基础。
本文重点分析了目前最先进的神经网络语言模型word2vec。
针对word2vec 词向量近反义区分能力弱的缺点,本文提出了一种同时使用词语语境的语义和情感信息构建词向量的方法,提升词向量的近反义区分能力。
具体地,本文使用远程监督方法,利用推文中的表情符号作为弱情感标签,扩展word2vec神经网络模型,将语境的语义和情感信息编码到词向量中。
本文称这种语义和情感结合的词向量为senti-word2vec词向量。
2. 融合语义和情感信息的推特事件检测。
传统的推特事件检测把语义相似的推文组织起来表征事件。
然而,许多语义特征提取方法的近反义区分能力有限,因此同一事件簇中的推文对事件可能表达不同的情感态度。
在情感信息的约束条件下,本文提出将推特事件簇进一步划分为事件支持簇,事件反对簇和事件中立簇。

The marketers study ego tweets to know the positive and negative view on a brand. [2]Broken Telephone: When the original message of the tweet is lost. While retweeting, people modify the content of the tweet according to their own understanding which alters the original information being spread. [2] A model similar to Tweetrush, based on predicting the flow of tweets is called Matchbox. It was originally developed to predict the movie preferences of the users based on the meta-data about movies. If the model has very strong predictive power, then pi = yi and the negative log-score is zero. If the model is not perfect, then the negative log-score will increase. Therefore, a smaller negative log- score means better model performance. [5] Automatic detection of tweets that provide Location-specific information will be extremely useful in convey-ing geo-location based knowledge about the users. Location Centric Word Co-occurrence is a weighting scheme, which uses mutual information score of tweet bigrams; the tweet's inverse document frequency (IDF); the term frequency (TF) of tweets, and the user's network score to determine the location-specific tweets. Bigram sequences are the different combination of keywords, numbers, hashtags used by users while tweeting.[8]Twitter data is known for its diverse uses, it is also used to predict real time events. One such model is Temporal model, which describes the time series of data. Each tweet has its own post time, depending upon the quantity of tweets of a particular location probability density function is calculated and then plotted exponentially. This can be used to predict the occurrence of events like earthquake, etc. in a particular area. [6] As te rmed by the scientist Bollen, “A tweet is a microscopic, temporally-authentic in- sanitation of sentiment”. Si nce tweets are crispy and brief, the public sentiment can be easily explored. Sentiment analysis, also known as opinion mining refers to the use of natural language processing, text analysis, and computational linguistics to identify and extract subjective information in source materials. One of the approaches of sentimental analysis is the A-NEW based approach, which uses its dictionary to provide pre- existing, normative emotional ratings for 1034 words along the three dimensions of valence, arousal and dominance. These values were then plotted in a 2D emotional circumplex model. The tweet emotion was determined its position within the model. [9]For a better insight about the sentiment analysis, it is important to know three the classes of sentiments,1.Positive: if the positive sentiments are increased, it is referred to be good. Admin LoginAfter the first implementation, data from your Home Timeline gets stored in the database and can be used to compare the results when analyzing live twitter data. It basically works on a formula of give and take; it takes an instruction and then performs an action for the user. It includes a list of commands and can also return various commands.In reference to twitter,Rest API:Twitter rest API makes use of the authorization account to perform actions on any user’s account. It provides the real-time data and allows us to perform various queries on it.Streaming API:Twitter’s streami ng API is that it is a long running request, which extracts the data when it is available.In TweetRush, we have used twitter Rest API to get the real-time data, . How beneficial a user will be in spreading the tweet? Constraint to this tool is only of limited data; the methodology works fine and provides genuine results.LimitationsSecurity and Privacy of users is of utmost concern for Twitter hence it restricts the extraction of data up to 100 recent tweets; therefore, not allowing us to show the analysis of more than 100 users.Twitter 4j API requires authorized access token to extract any kind of data and it is restricted to the information of only 15users per API call. Although limit value of a single token is reset but it is done only after 15 minutes.TweetRush can be improved by applying it on large size of data.Future ScopeTargeting the most influential user across all social media is termed as Influencer marketing. It is easier to look for an influencer on YouTube based on the number of views and subscriptions, but there is no quantitative measure to look for the same on Twitter, so this where TweetRush can be implemented.TweetRush can also be combined with sentimental analysis to observe the mindset of user with maximum influential factor. In reference to a research conducted on Punjab Legislative Assembly Election 2017, sentiment analysis was used to predict the outcome of the elections, the programming language python was used for extraction of tweets and tweets were categorized based on NLP. Now, the authenticity of this research can be proved, by looking into the Source user of each tweet and each user’s network, using TweetRush. network services have become a viable source of informa-tion for users.In Twitter,information deemed important by the community propagates through retweets.Studying the characteris-tics of such popular messages is important for a number of tasks, such as breaking news detection,personalized message recommen-dation,viral marketing and others.This paper investigates the prob-lem of predicting the popularity of messages as measured by the number of future retweets and sheds some light on what kinds of factors influence information propagation in Twitter.We formulate the task into a classification problem and study two of its variants by investigating a wide spectrum of features based on the content of the messages,temporal information,metadata of messages and users,as well as structural properties of the users’social graph on a large scale dataset.We show that our method can successfully pre-dict messages which will attract thousands of retweets with good by utilizingmachine learning techniques to predict whether and how often newmessages will be retweeted in the future.We treat the problem asa classification task.First,we train a binary classifier with positiveand negative examples of messages which will be retweeted in the future.Second,we train a multi-class classifier which predicts thevolume range of future retweets for a new message.To build theclassifiers,we investigate a wide spectrum of features to determinewhich ones can be successfully used as predictors of popularity,including the content and topical information of messages,graphstructural properties of users,temporal dynamics of retweet chains and meta-information of users.We conduct our experiments on alarge scale dataset.The results suggest that we can successfullypredict whether a message will be retweeted or not.Furthermore,we can also predict the volume of retweets with good predictiveperformance.Similar work by Suh et al.[2]studied a variety of fac-tors that might influence retweets without explicitly showing their effectiveness in a classification framework.2.PROBLEMS&FEATURESWe cast the problem of predicting the popularity of messages into two classification problems:1)a binary classification prob-lem that predicts whether or not a message will be retweeted,and,2)a multi-class classification problem that predicts the volume ofretweets a particular message will receive in the near future.Twomessages are considered identical if they share the same MD5 value.We sort all such messages by ascending time order,form-ing a chain of messages.Thefirst message in the chain is the ear-liest version of the message in our dataset and all later messagesin the same chain should contain at least one“RT”term.For thebinary classification problem,for n messages in a chain,thefirst n−1messages are considered as“positive instances”and the last one as a“negative instance”.In addition,all other messages whichare not in any chains are also considered as“negative instances”.For the multi-class classification problem,the number of messagesfollowing a specific message is treated as the number of retweetsthis message will receive.Therefore,for all messages,we assigna non-negative integer value to represent the number of subsequent retweets.It is difficult to predict the exact number of retweets aFigure1:Retweet much higher than in its training set.Therefore,rather than directly predicting these integer values,we relax the problem by defining several categories to rep-resent the volume of retweets and predict these categories instead. We investigate a wide range of possible features including content features,graph topological features,temporal features and meta-data features,all of which are applicable to the two classification tasks.For content features,we use TF-IDF scores as a baseline and utilize Latent Dirichlet Allocation(LDA)to obtain the topic distributions for each message.For topological features,multiple popular features are considered,including global and local struc-tures,such as PageRank,degree distribution,local clustering coef-ficient and reciprocal links.We also assume that users may track hot topics and may quickly switch topics over time.Therefore, for temporal features,we measure the time difference between the current message and the origin within the chain,the time differ-ence between the current and the previous tweet,the average time difference of consecutive messages in the same chain and the av-erage time a user’s messages get retweeted.For meta information features,we are mainly interested in whether a message has been retweeted before(Retweet Before)and how many times in the past the messages generated by a particular user have been retweeted (User Retweet).Other user activities such as the total number of messages a user produced are also considered.3.EXPERIMENTSWe run our experiments with messages collected in November and December2009,as well as the immediate social graph of the users which are active in this time period.The dataset contains 10,612,601messages and2,541,178users.For the binary classi-fication problem,we report Precision,Recall and F1score.For the multi-class classification problem,we report accuracy for each class.Instead of directly predicting the exact number of retweets, we divide the messages into different retweet volume“classes”:0:Not retweeted,1:Retweeted less than100,2:Retweeted less than10000,3:Retweeted more than10000,similarly to[1].We binned messages with retweets(size equals10)and plot the dis-tribution in Figure1,showing that a large number of messages do not receive any significant retweets(less than10)and a significant amount of messages also have more than10000retweets.Three messages with most retweets in Class3are shown in Table1as examples where thefirst one is about entertainment,the second is related to hockey and the third one is related to IT.We use Logistic Regression as the classifier,as we found it to be the most stable in preliminary experiments.We train the classifier on one week and test it on the next week and the results are the averages over four such experiments.We compare the results to two obvious baselines.One is based on whether a messages has been retweeted or not in the past,and the other uses the TF-IDF scores for terms in each message.The re-sults are shown in the upper part of Table2.For both baselines,the F1score is roughly around0.27,with relatively low Precision and Recall scores.For our method,the best performance is achieved by using“TF-IDF”,“LDA”,“degree distribution”,“Retweet Be-fore”and“User Retweet”features while all measures are much better than both baselines.In order to investigate the effective-ness of each feature,we remove individual features and see how the performance is affected.This is shown in the middle of Ta-ble2,where thefirst column shows which feature have been taken away.We observe that the performance drops significantly when “degree distribution”and“Retweet Before”are removed,implying that they contribute greatly to the overall performance.We con-jecture that in Twitter,users mainly see messages from theirfirst level friends whom they are directly following.Therefore,the like-lihood that some of a user’s followers will retweet a new message depends on how many followers the user has.Thus,the effect of in-degree is obvious to some extent.For out-degree,since many messages which will be retweeted in the future have already been retweeted,a user with limited friends may face difficulties in see-ing such messages.For multi-class classification,the lower part of Table2shows the performance achieved by using the best fea-tures in the binary classification.The results are extremely good in Class0and Class3but poor in Class1and Class2,indicating that messages only attracting a small audience might be very dif-ferent from the messages which receive huge numbers of retweets. After adding“Temporal”features,shown in the third column,the performance on Class0still holds but improvements in Class1and Class2are observed with some decrease of performance of Class 3.One explanation is that unlike popular messages which receive tens of thousands of retweets,normal messages only attract a small audience and users lose interest in them very quickly.Therefore, temporal features have a stronger effect on these messages with low and medium volume of retweets,compared to highly popular er activity features can further improve the performance marginally,shown in the fourth column in Table2.
