四种飞机积冰预报方法的比较与分析
四种飞机积冰预报方法的比较与分析作者:葛思源来源:《价值工程》2017年第14期摘要:飞机积冰是对航空飞行安全危害最严重的气象要素之一。
本文利用2013年无锡等地的飞机积冰报告资料,对目前常用的四种飞机积冰诊断预报方法进行检验,比较这四种方法对飞机积冰个例预报的准确性。
结果表明,仅考虑温湿条件的霜点法对云中过冷水滴含量的影响估计不足,预报效果差,漏报率偏高。
修正霜点法对飞机积冰的预报效果明显改善,预报准确率达70.0%以上。
假霜点判别法和积冰指数法对飞机积冰有无预报效果均较好,准确率达88%,漏报率也较低。
但积冰指数法对积冰强度预报明显偏强,空报率也略偏高。
Abstract: The aircraft icing is one of the most serious meteorological factors to aviation safety. By using the aircraft icing reports of Wuxi etc. in 2013, this papaer takes an inspection of the four commonly used methods of aircraft icing diagnosing and forecasting, and the accuracy of the four methods are compared for the case of aircraft icing prediction. The results show that the frost point method, which only considers the temperature and humidity conditions, is not enough to estimate the influence of the supercooled water droplets in the cloud, and the prediction effect is poor, the missing report rate is high. Modified frost point method for aircraft icing forecast effect is improved obviously, and the forecast accuracy rate can achieve over 70.0%. False frost point discrimination and icing index method for aircraft icing prediction all have a good effect, whose accurate rate is 88%, and the missing rate is lower. 深度稀疏自编码网络识别飞行员疲劳状态CHU Yin-xue;LU Zhi-jun;QIU Xu-yi;WU Qi【摘要】针对飞行员疲劳状态识别的复杂性和准确性,提出一种基于脑电信号的深度学习模型.首先对飞行员脑电信号进行滤波分解,提取delta波(0.5~4 Hz)、theta波(5~8 Hz)、alpha波(7~14 Hz)、beta波(14~30 引言随着飞行器自动化设计技术的不断进步和人类对航空安全的不断重视,飞机在可靠性和安全性方面有了长足的进步,由于飞机机械故障导致事故的比例从80%降到了20%,但是因飞行员操作失误造成事故的比例则逐步增多[1-3].疲劳飞行是引起飞行员操作失误的主要原因之一,据美国国家安全局近40年的调查统计发现,多于300起航空事故归因于飞行员疲劳[4].因此,减少因飞行员疲劳造成的飞行事故,对航空安全具有重大意义.飞行员疲劳,即飞行员由于工作负荷、飞行各阶段物理、生理和心理因素等,有机体的生理过程不能使其机能继续维持在安全飞行这一特定的水平上,主要表现是身体工作能力下降,思维和操纵警觉水平下降[5-6].目前飞行员疲劳监测可通过客观测量和主观评价的方法进行.主观评价是通过飞行员自我记录表、主观调查表、斯坦福睡眠尺度表或皮尔逊疲劳量表等综合评定飞行员疲劳状态的检测方法.客观测量是通过测量一些与疲劳状态相关的生理指标,如眼睑闭合、头部运动、手部运动、心率、脉搏等来判断飞行员的疲劳状态.相比于主观评价,客观测量更能量化地反映飞行员疲劳程度,成为疲劳检测的主要发展方向[7-8].大量神经细胞群在大脑神经中枢传输控制行为意识的信号时产生突触后电位的变化形成脑电信号.脑电信号作为众多生理指标中的一个,被誉为是疲劳状态识别的“金标准”.如Alireza Ghaemi等用脑电信号来识别左右手的活动[9],平均准确率达到76.24%;南京航空航天大学的陈春晓等[10],用脑电信号的频谱信息来评估观看3DTV的视觉疲劳,对比主观调查表情况,得出对疲劳的识别平均准确率达到87%.因此采用脑电信号监测飞行员疲劳状态具有实际应用价值.目前脑电特征的提取方式主要集中在两个方面:基于脑电信号的时域和频域特征提取以及基于机器学习和深度学习的特征提取方法.基于时频的分析方法包含傅里叶变换(fourier transform,FT)、经验模态分解(empirical mode decomposition,EMD)、信号的熵信息以及小波变换等.Gino Slanzi等[11]提取了脑电信号的近似熵等特征,用逻辑回归预测实验者是否点击网页,准确率为71.09%;北京工业大学的李明爱等[12]利用小波包和熵准则提取对脑电信号的最优频段,作为支持向量机的输入向量,识别大脑想象下不同运动情况,准确率最高可达到81.75%.Shufang Li等[13]利用经验模态分解EMD[14]方法将脑电信号分解出固有模态函数(intrinsic mode functions,IMFs),提取了IMFs的变异系数和波动指数作为特征,并用支持向量机(support vector machine,SVM)作为分类器实现对脑电信号的分类.经验模态分解以及其改进的总体经验模态分解(ensemble empirical mode decomposition,EEMD)在脑电等信号的特征提取上有很重要的应用,但是其缺乏理论支持,基于此,J´erˆome Gilles[15]提出了经验小波变换(empirical wavelet transform,EWT),与EMD相比,EWT在信号以及图像的处理上都具有一定的优势.Abhijit Bhattacharyya等[16]利用经验小波变换识别癫痫病病灶区域的脑电信号,并取得了良好的效果.相较于基于人工经验的脑电信号特征提取方式,基于机器学习以及机器学习和人工经验相结合的脑电特征提取方法也在不断发展.Yu Zhang等[17]利用稀疏贝叶斯多通道典型相关分析实现对脑电信号特征识别;Abdulhamit Subasi等[18]利用小波变换提取脑电信号的特征并结合传统方法主成分分析(principal components analysis,PCA)、独立成分分析(independent component correlation algorithm,ICA)、潜在狄利克雷分配(latent dirichlet allocation,LDA)和SVM方法对特征数据降维以及分类,并对不同方法的结果进行比较分析.随着深度学习技术的不断完善,许多图像特征提取的方法也被应用在了脑电信号特征提取上,通过适当改变网络的结构都取得了不错的学习效果.Baldwin和Penaranda[19]提出自适应的人工神经网络通过提取脑电信号的特征来识别操作员的工作负荷状态;成都电子科技大学的严博等[20]利用稀疏自动编码器无监督地学习正常人和病患的脑电信号,并取得高达100%的识别率;哈尔滨工程大学的柴新等[21]利用自动编码器来识别人的情绪变化,识别率高达81.81%;Mehdi Hajinoroozi等[22]通过深度卷积神经网络分析脑电信号预测驾驶员的认知状态与驾驶行为.针对飞行员正常、微疲劳、极度疲劳状态下的脑电信号,不仅需要提取各自代表性信息,还需要去除冗余信息增加计算效率,以保障高效率高准确率的疲劳状态识别,达到及时告警目的.基于此,本文在稀疏自动编码器(sparse auto-encoder,SAE)的基础上,引入多层学习的方法,提出一种新的深度稀疏自编码网络[23](deep sparse auto-encoding network,DSAEN),以使提取到的特征能最大程度地代表原始脑电信号,计算效率得到最大限度优化.此外,为了实现飞行员不同疲劳状态的精确分类,通常需要在二分类的基础上在增加一对多或一对一的识别达到多分类的目的.Softmax分类器[24]是一种多分类器,是逻辑回归分类器的推广,通过最大似然估计求解分类模型,最大化保留不同类别的代表性特征,适合作为深度学习的顶层分类器,进行飞行员疲劳状态(非疲劳、微疲劳、极度疲劳)识别.通过以上分析,提出一种基于DSAEN-Softmax的飞行员脑电特征自学习和状态识别模型,并与单层的稀疏自编码网络-Softmax和传统PCA-Softmax模型比较,方案流程图如图1所示.图中SAEN(sparse autoencoding network)为单层稀疏自编码网络.图1 方案流程图Fig.1 Program flow chart2 DSAEN-Softmax模型2.1 自动编码器标准自动编码器(auto-encoder,AE)包含编码和解码两部分,分为3层,分别为输入层x、隐藏层h和输出层y.编码过程:通过非线性映射函数将输入变量x以一定的方式映射到隐层h,由此h 便成为了输入x的另一种表现形式.编码的原理为其中:x∈[0,1]d,h∈[0,1]d,W是d×d′的权重矩阵;b为输入层偏置向量;θ={W,b},s(·)为Sigmoid函数,如式(2)所示.解码过程:将隐藏层形成的编码h映射到输出层y,输出层具有和输入层相同的单元数,映射关系如下所示:式中:y∈[0,1]d,W′是隐藏层到输出层的权重矩阵,且有W ′=WT;b′为隐藏层的偏置向量;θ′={W ′,b′}.通过训练来调节参数θ和θ′,使得输入与输出之间重构误差函数-代价函数最小.传统AE采用的代价函数为均方误差(mean squared error,MSE),即式中:m为样本的数量;xi为输入向量;yi为输出向量;θ为网络中所有参数的集合.为解决AE中过拟合的问题,通常会在代价函数中增加一个权重衰减项,权重衰减项相当于对网络的权重矩阵做了一定的限制,代价函数变为式中:λ决定了权重衰减项在代价函数中所起的作用;l为网络的层数;sl为l层单元的个数;ωji为权重矩阵中角标为j,i的元素值.2.2 稀疏自动编码器由于AE学习到的抽象特征有冗余的缺陷,为了克服这一不足,在AE的基础上,增加L1的正则化限制,得到一种稀疏自动编码器(sparse auto-encoder,SAE).SAE在编码解码过程中,对其中大多数神经元进行稀疏约束,去除特征冗余情况.它通过对每个隐藏层单元的响应添加约束条件,使隐藏层的大多数神经元处于“抑制”状态,只有少数神经元处于“兴奋”状态,反映到数字模型中即通过向代价函数添加稀疏约束项来实现,SAE网络原理如图2所示.在AE的代价函数中,添加以下稀疏约束条件:式中:ρj为隐藏层单元神经元的平均激活度;ρ是人为设置的参数,一般比较小,从式(7)-(8)可看出,ρj和ρ越接近,代价函数就越小;β决定了稀疏约束项在代价函数中所起的作用.图2 Softmax分类器Softmax分类是逻辑回归分类的一种扩展,在多分类问题上有很重要的应用.其通过最大似然估计求解分类模型,最大化地提取信息中本质特征,从而区分不同类别.记类标签y可以取r个不同的值,对于训练集{(x(1),y(1)),···,(x(m),y(m))},类标签为ym∈{1,2,···,r},r为分类数.对于给定的输入x(n),用假设函数hλ(x(n))针对每一类k 估算出概率值P=(y(n)=k|x(n)),k=1,···,r.hλ(x(n))输出一个r维列向量(和为1),每行表示当前类的概率.假定假设函数hλ(x(n))为hλ(x(n))=对于样本x(n),选择概率p(y(n)=k|x(n);λ)值最大的对应的类别k作为当前样本的分类标签,并与样本本身的标签做对比,如果一致则分类正确,否则分类错误,分类准确率(accuracy rate)可表示为2.4 DSAEN-Softmax模型深度稀疏自编码网络(deep sparse auto-encoding network,DSAEN)是由若干个SAE组成,原始数据作为第1层SAE的输入,逐层训练,训练好的L-1层的输出作为第L层的输入,能充分体现深度理论的优势,弥补传统浅层结构在有限样本以及计算单元的情况下对复杂函数的表示能力有限,对特征的学习以及泛化能力不足[25].在此基础上,建立一种基于DSAEN的飞行员疲劳状态识别框架,如图3所示,首先采用无监督训练方式,逐层训练DSAEN网络得到较为优化的网络权值,然后将这些权值作为整个模型的初始化参数值,通过在网络顶层附加Softmax分类器对整体网络参数进行进一步训练和细微调节.图3 2000系统,包含国际10-20系统中的64个参考电极,采样频率为160Hz,采集64通道的脑电信号,如图4所示.图4所示的脑电采集装置中F通道和P通道所在的区域采集的信号与人的精神兴奋程度密切相关,为了减少数据的冗余与计算量,根据相关文献[26-27],选择FP1通道的数据作为实验中主要处理的脑电信号数据.图4 64导的10-20系统Fig.4 64 channel of 10-20 system实验情形设置:飞行员模拟连续6小时的旧金山和洛杉矶之间来回飞行,持续飞行时间段为8:00~14:00,随着飞行时间的增加,飞行员的身体会呈现不同的疲劳状态.分别截取不同时段作为非疲劳、微疲劳、极度疲劳状态的数据集.共有40名飞行员(身体素质良好,且有3年以上飞行经验)参与飞行实验.实验采集40个飞行员的脑电数据,包含40个非疲劳信号的数据,40个微疲劳信号的数据和40个极度疲劳信号的数据,共120个数据.每个飞行员产生的数据集含代表非疲劳、微疲劳和极度疲劳3种状态的3个信号矩阵,每个信号矩阵维度为64×192000,从采集得到的信号数据中选择FP1通道的脑电信号数据作为一个样本.将数据集进行如下划分:1)40个非疲劳信号矩阵,按4:1进行划分,32个数据集作为训练样本,8个数据集作为测试样本;2)40个微疲劳信号矩阵,按4:1进行划分,32个数据集作为训练样本,8个数据集作为测试样本;3)40个极度疲劳信号矩阵,按4:1进行划分,32个数据集作为训练样本,8个数据集作为测试样本.3.1 脑电信号预处理由于脑电信号具有较强的时变敏感性,在采集过程中掺杂大量噪声,在分类识别之前需进行滤波处理.一般,脑电信号的基本特征包括频率、周期、幅值、相位等,其中频率特性具有突出的特点.根据频率和幅值的特性,脑电信号主要可分为δ波(0.5~4Hz)、θ波(5~ 8Hz)、α波(7~ 14Hz)和β波(14~ 30Hz).不同特性的波在不同的状态下信号的表现不同[28],如成人清醒状态下几乎不会出现,只有睡眠时才会出现δ波;θ波属于正常儿童的脑电图主要成分,但对于成年人,在神经系统被抑制时会增多,可以作为抑郁和困倦的检测指标等.采用滤波变换,提取出α波(7~14Hz)、δ波(0.5~4Hz)、θ波(5 ~ 8Hz)和β波(14 ~ 30Hz)这4种节律波段,再对4种节律波段加和组合成脑电信号,如图5所示.由图可见,原始的脑电信号中不仅包含4种基本节律波段,还包含有频率较高的与疲劳状态识别无关的成分,在经过滤波变换后所得到的频谱图中,高频信号已经被滤除,得到了符合需要的较纯净的脑电信号.图5 原始脑电信号滤波分解重组Fig.5 The decomposition and reconstruction of the filters根据得到的4种基本节律,有基于脑电信号节律的疲劳指标[29]:这4个指标是根据不同节律功率谱的比值计算得到的,相关节律的功率谱计算公式为PS(f)表示功率谱密度在功率f处的振幅.基于脑电信号节律功率谱曲线面积的疲劳指标趋势如图6所示.图6中(a)(b)分别表示在非疲劳状态和疲劳状态下脑电信号节律的4个指标在窗口数为20(即将脑电信号分为20段,分别求每段信号的功率谱比值)的情况下功率的谱比值.在不同的疲劳状态下,脑电信号的4个指标功率比值有较明显的差别.图6 识别模型的搭建由于深度网络具有的优势,一般情况下,较多的隐含层往往会带来较好的特征学习效果,但是会导致模型过过于复杂,计算量较大甚至产生过拟合的问题.针对本实验,本文搭建了不同层数的深度稀疏自编码网络观察层数对于识别正确率的影响.为了避免网络的节点数对实验产生的影响,截取原始的输入数据为1600维,同时设置每层隐含节点数160个,分别搭建含1-7层隐含层的网络,得到平均识别正确率如图7所示. 由图7可知,随着隐含层数的增加,识别的正确率也在增加,考虑到实际输入的数据维度较大,选择含有3层隐含层的稀疏自编码网络.输入信号维度为19200维,设置不同的隐含层节点数,得到的识别结果如图8所示.由图8可知,在3层的隐含层情况下,隐含层节点数维3000-800-200时,识别准确率较高可以达到0.9以上,相较于其他的节点数可以获得更好的识别准确率.因此,在实验中选择搭建隐含层为3000-800-200的稀疏编码网络.图7 units以MATLAB为编程工具,对预处理后的脑电信号矩阵进行DSAEN处理,本文设置各个SAE的参数:隐含层数=3,稀疏比例=0.05,L2正则化系数=0.001,稀疏正则化系数=4,并将特征提取的结果作为Softmax分类器输入的优化特征,对DSAEN-Softmax进行有监督训练.最终再将测试集的数据输入模型得到疲劳状态的识别结果.3.3 疲劳识别根据DSAEN-Softmax模型的原理,研究实现了飞行员疲劳状态识别,具体技术路线如图9所示.首先,对飞行员脑电信号进行降噪滤波预处理,获取脑电动态节律;其次,提取4个节律的频域特征(如图6所示)作为DSAEN模型的输入向量,进行多层网络学习,得出飞行员疲劳状态的抽象特征;最后,再把抽象特征作为顶层分类器Softmax 输入,进行有监督的训练学习,同时对DSAEN的网络参数进行微调.最终将测试集中的数据输入到网络中,完成对飞行员疲劳状态识别判断.基于DSAEN-Softmax模型的识别结果如表1所示,根据识别的结果,在39维的情况下,平均识别正确率可以达到97.5%,此时的识别效果最好,随着最终特征提取的维度下降,识别的准确率在下降,模型的稳定性也不断下降.本文使用单层的稀疏自编码网络(SAEN)对预处理后的脑电信号进行特征提取,最终分别得到在39维、20维、10维、3维状态下的识别结果.相较于深层次的网络,该模型的识别效果有明显的下降.最高的平均识别正确率维69.2%,说明深层次的网络可以更好的完成原始信号的特征学习.考虑到PCA作为一种简单且易用的数据降维方法,笔者设计了PCA-Softmax模型对预处理后的脑电数据进行特征提取以及分类识别.结果显示PCA模型的分类识别正确率较低,最高仅为31.7%.且随着维度的下降,几次实验中识别正确率的波动也比较大.由图10所示,在相同的维度下,DSAEN模型具有较好的识别效果,而PCA的特征提取在该实验中的结果较差.在样本数据有限的情况下,本文提出的深度稀疏自编码网络对于脑电信号特征有更强的学习及泛化能力.图9 结束语基于任务的飞行员疲劳状态下的脑电信号,经滤波变换重组后,表征飞行员疲劳特征时频成分都被作为深度学习的输入向量,而不是传统的人工提取几个特征作为分类器的输入向量,因此,所提的方法最大限度弥补人为研究经验的不足.同时,实验结果也显示,在样本数据有限的情况下该模型能够高准确率且稳定的地识别出飞行员疲劳状态,具有较高实用价值.对比单层的SAEN-Softmax模型和传统方法PCASoftmax模型的实验结果,所提出基于DSAENSoftmax的飞行员疲劳状态识别模型,能够在无监督状态下自主学习不同状态下飞行员脑电动态节律特征,最大程度地提取出表征飞行员非疲劳、微疲劳、极度疲劳状态下的抽象特征,平均识别准确率高达97.5%,高于单层SAEN-Softmax模型和传统PCASoftmax模型.因此,基于DSAEN-Softmax的飞行员疲劳状态识别方法具有较好的实验效果和可行性. Farmers put cameras and sensors on drones that use AI to automatically check on the crops and look for problems. The AI can spot signs of disease, drought, nutrient deficiencies, or pest infestations way earlier than a human walking through the fields could.That's important because treating crop problems quickly helps prevent bigger damage and wasted food. Plus the drones cover the whole field way faster than a person could. Using AI drones lets farmers take better care of their crops with less labor and chemicals needed. How cool is that?Another awesome use of AI is in robotics for things like automated harvesting, weed removal, and pruning. The robots have cameras and sensors that use AI vision to identify the crop versus a weed, or the ripe fruit versus unripe ones. Then the robot's arms can just grab the right things while leaving the rest untouched.Those AI robots are way more precise and efficient than having human workers do all that by hand. The AI takesin all those real-time readings and uses machine learning algorithms to optimize irrigation and fertilizer schedules. That way, every single plant gets exactly the right amount of water and nutrients it needs, when it needs it.Not only does this AI precision farming grow more food, it also prevents over-watering and excessive fertilizer runoff. So it's better for the environment by cutting down on freshwater waste and nutrient pollution in rivers and streams from the farms. I think that's really important for protecting nature!Weather prediction is another area where AI helps farmers a ton. You know how weather forecasts these days use computer models with tons of data inputs from meteorological sensors across the globe? Well those models use machine learning, which is a kind of AI. The models can analyze patterns in gigantic climate datasets to predict temperature, precipitation, wind patterns and more.Having accurate predictions of rain, frost, heat waves and other conditions allows farmers to take steps to protect their crops at the right times. AI weather forecasting means higher yields and less crop losses from unexpected freak events.Something else cool is using AI for monitoring livestock like cows and chickens. There are systems with cameras and audiosensors that use AI to detect unusual animal behaviors that could signal illnesses, distress, or other issues. The AI learns the normal sounds and movements, so it can alert the farmer if anything seems off with an animal's activity or vocalizations. S h e l h a m e r等[5]提出了一种深度㊁粗层和细层相结合的双路径C N N跳跃结构,实现了对脑癌的精确分割.C h e n g等[6]利用T1-M R I数据研究了脑肿瘤的三级分类问题,该方法先利用图像膨胀扩大肿瘤区域,然后将其划分为逐渐细小的环状子区域.D a s等[7]使用包含3064张T1加权对比增强M R I图像的卷积神经网络识别各种脑癌,如胶质瘤㊁脑膜瘤和脑垂体瘤.C N N模型通过基于可变大小的卷积滤波器/核调整卷积网络的大小,获得了94%的准确率.B a dža等[8]提出了一种新的C N N结构,该结构基于对现有的预训练网络的改进,使用T1加权对比增强磁共振图像对脑肿瘤进行分类,该模型的准确率为96.56%,其由两个10倍交叉验证技术组成,使用增强图片.M z o u g h i等[9]采用基于灰度归一化和自适应对比度增强的预处理方法,提出了一种完全自动化的脑胶质瘤三维细胞神经网络模型,用于脑胶质瘤的低级别和高级别分类.深度学习中的C N N是目前较好的图像处理方法[10].A l e x N e t[11],V G G[12]等C N N的发展证明了增加网络深度能在一定程度上提高网络性能.但卷积核作为其中数量最多的参数,对网络性能的影响较大[13].若只通过简单的网络层堆叠增加深度会导致网络出现梯度消失和过拟合的情况[14].为解决这类问题,本文提出基于改进E f f i c i e n t n e t V2网络的方法,实验结果表明,与其他算法相比,将其运用到脑肿瘤分类的任务中,准确率更高.1模型架构1.1E f f i c i e n t N e t V2网络模型E f f c i c e n t N e t V2[15]是根据E f f i c i e n t N e t[16]的基本思想进行改进的网络.该网络通过改变网络的深度㊁宽度和输入图像分辨率的参数提高网络性能[16].E f f i c i e n t N e t V2是一种采用神经结构搜索技术(n e u r a l a r c h i t e c t u r e s e a r c h,N A S)和复合模型扩张方法的分类识别网络,它能选择最优的复合系数,即按比例扩展网络的深度㊁宽度和输入图像分辨率3个维度,以找到最大识别特征精度所需的最优参数.E f f i c i e n t N e t V2通过自适应地平衡3个维度,成功减少了模型训练的参数量和复杂度,从而大幅度提高了模型性能.与单一维度的缩放相比,这种方法能获得更好的效果,同时在训练速度上也有明显的提升.E f f c i c e n t N e t V2网络主要由F u s e d-M B C o n v[17]和M B C o n v模块堆叠而成,网络结构列于表1.理论上,随着硬件设备的优化和算法设计的改进,普通卷积在某些条件下可能会比之前更有效.为验证这两者对卷积计算速度的影响,在浅层卷积使用F u s e d-M B C o n v,在深层卷积使用深度可分离卷积M B C o n v.Copyright©博看网. All Rights Reserved.2711吉林大学学报(理学版)第61卷图像的特征信息.E f f i c i e n t N e t V2网络模型中M B C o n v模块加入了S E注意力机制,S E注意力机制只考虑对通道间信息进行编码,而忽略了位置信息的重要性,导致注意力机制提取脑肿瘤的特征信息不全面,从而使模型的分类精准度较低.而C A注意力模块恰好可以更准确地获取输入的位置特征信息,有助于网络更准确地定位感兴趣的对象,同时使网络覆盖更大的区域.坐标注意力模块可以自适应地选择输入脑肿瘤图像的感受野大小和位置,使其能更好地适应不同尺度和形状的输入图像,从而提高脑肿瘤分类模型的鲁棒性和泛化能力,因此将S E注意力模块替换为C A注意力模块.在替换时,需要保持注意力模块的输入和输出维度不变,以保证模型的正确性.为使该网络计算速度更快,对量化更友好,进一步提高脑肿瘤分类的正确率,本文将原网络中的S i L U激活函数换为H a r d-S w i s h激活函数,改进后的网络结构如图3所示.图3改进后的网络结构F i g.3I m p r o v e dn e t w o r k s t r u c t u r e该实验脑肿瘤M R I图像的样本数量较少,网络中用D r o p o u t层减少训练网络中部分神经元的活性,以防止网络过拟合的发生,B N(b a t c hn o r m a l i z a t i o n)[20]通过减少梯度对参数或其初始值尺度的依赖,从而能使用更高的学习率,极大加快了深层神经网络的训练速度.2.2激活函数在原E f f i c i e n t N e t V2网络使用的S i L U激活函数是S w i s h激活函数的一个特例,当β=1时, S w i s h激活函数称为S i L U激活函数.该激活函数存在一些潜在的缺点:S i L U激活函数的导数对于较大的负输入可能会变得非常小,可能导致反向传播期间梯度消失.对于深度神经网络,会导致训练变得困难;虽然S i L U是一种灵活的激活函数,但它表达能力有限,可能会限制其在数据中表示复杂函数和模式的能力;S i L U激活函数缺乏可解释性,与其他一些激活函数(如S i g m o i d或双曲正切)不同, S i L U函数没有明确的概率解释,可能会使解释模型的行为和输出的含义变得更困难.S i L U激活函数曲线如图4所示.H a r d-S w i s h激活函数[21]是S w i s h激活函数非线性改进版本,其计算速度更快,计算过程只涉及基本的数学运算,如乘法和加法,实现相对简单,而S i L U涉及指数运算,计算速度相对较慢.并且H a r d-S w i s h激活函数对量化更友好,更适合深度卷积网络,同时也可增加脑肿瘤分类的正确率.因此本文将原网络中的S i L U激活函数换为H a r d-S w i s h激活函数.H a r d-S w i s h激活函数曲线如图5所示.训练卷积网络时,在梯度下降的过程中,梯度消失是一个常见的问题.相比于S i L U激活函数, H a r d-S w i s h激活函数在输入接近于0时的梯度更大,因此在这种情况下出现梯度消失问题的概率更小.H a r d-S w i s h激活函数更复杂,因此在训练深层神经网络时可以更好地捕捉特征,从而提高训练效果.S w i s h函数表达式为S w i s h(x)=xˑS i g m o i d(βx),(1)其中β表示可调参数.H a r d-S w i s h函数表达式为H a r d-S w i s h[x]=xˑR e L U(x+3)6.(2)Copyright©博看网. All Rights Reserved.图4 S i L U 激活函数曲线F i g .4 S i L Ua c t i v a t i o n f u n c t i o n c u r ve 图5 H a r d -S w i s h 激活函数曲线F i g.5 H a r d -S w i s ha c t i v a t i o n f u n c t i o n c u r v e 3 实验与分析3.1 数据集与预处理本文使用的脑肿瘤图像数据集来自公开数据集f i g s h a r e (w w w.f i gs h a r e .c o m ),该数据集由233名患者的脑部M R I 图像组成,包括横断面㊁冠状面和矢状面共3064张图像,其中脑膜瘤切片708张,胶质瘤切片1426张,垂体瘤切片930张.本文预处理首先将脑肿瘤图像数据集中的每张图像调整尺寸大小至512像素ˑ512像素;其次将M R I 图像原始数据信息进行特征提取,得到带有标签的样本集合;最后将数据集按照80%和20%划分为训练集和验证集.分类标签包括脑膜瘤㊁胶质瘤㊁垂体瘤3种类别标签.3.2 参数设置与评价指标3.2.1 实验环境本文实验基于P y T o r c h 深度学习框架,使用P y t h o n 3.6语言实现,搭建了基于改进E f f i c i e n t N e t V 2网络的脑肿瘤图像三分类框架.在L i n u xC e n t O S 7环境下完成,C U D A 版本为10.2.硬件设备为:I n t e l (R )X e o n (R )C P U E 5-26502.2G H z C P U ,N V I D I A T I T A N X Pˑ2显卡,12G B ˑ2显存.3.2.2 参数设置在训练过程中,本文实验使用随机梯度下降(S G D M )优化器优化所设计的模型,网络模型训练过程中涉及的超参数设置列于表2.表2 训练过程的超参数设置T a b l e 2 H y p e r p a r a m e t e r s e t t i n g s f o r t r a i n i n gp r o c e s s 超参数迭代次数批次大小优化器初始学习率D r o p o u t 数值2008S G D M 0.0030.2 因为仅凭准确率评价指标并不能充分证明网络设计及参数调整的合理性,因此,为全面评价本文改进的E f f i c i e n t N e t V 2网络的性能,使用准确率和混淆矩阵作为评价指标.混淆矩阵是一种用于总结分类算法性能的技术.如果每个类别中的观察数不相等,或者数据集中有两个以上类别,则仅凭分类准确性可能会产生误导.混淆矩阵提供真阳性(T P ),即预测为正㊁事实为正;真阴性(T N ),即预测为负㊁事实为负;假阳性(F P ),即预测为正㊁事实为负;假阴性(F N ),即预测为负㊁事实为正的值.在经过准确率和混淆矩阵进行网络模型评估后,这些值可用于计算本文算法的准确率㊁精确度㊁召回率和F 1-S c o r e 的数值[22-23].其中F 1-S c o r e 是准确率和召回率的调和平均评估指标[24].本文用这5个评价指标作为实验结果的评判标准.准确率表示所有预测正确的样本占总样本的百分数,用公式表示为A c c u r a c y=T P +T N T P +T N +F N +F P ˑ100%.(3)精确度表示预测正确的正类样本占所有预测为正类样本的百分数,用公式表示为3711 第5期崔 博,等:基于改进E f f i c i e n t N e t V 2网络的脑肿瘤分类方法 Copyright ©博看网. All Rights Reserved.4711吉林大学学报(理学版)第61卷P r e c i s i o n=T PT P+F Pˑ100%.(4)召回率表示预测正确的正类样本占所有事实正类样本情况的百分数.召回率在医学图像分类问题中又被称为灵敏度,灵敏度越高,说明对病灶区域越敏感,用公式表示为R e c a l l=T PT P+F Nˑ100%.(5) F1-S c o r e表示精确率和召回率的调和平均数,综合考虑了精确率和召回率,是一个综合评价指标,通常被用作分类模型性能的重要指标之一[25],用公式表示为F1-S c o r e=2ˑP r e c i s i o nˑR e c a l lP r e c i s i o n+R e c a l l.(6) 3.3实验结果与分析为证明本文基于改进的E f f i c i e n t N e t V2网络的M R I脑肿瘤图像分类算法的有效性,实验选择引入坐标注意力机制的分类模型,模型中还结合了H a r d-S w i s h激活函数㊁B N以及D r o p o u t层.同时选择了S E,C B AM(c o n v o l u t i o n a l b l o c k a t t e n t i o nm o d u l e)和E C A(e f f i c i e n t c h a n n e l a t t e n t i o n)注意力模块进行对比实验,观察模型算法并进行分析.数据集上训练和验证过程的准确率和损失函数曲线如图6所示,其中:灰色曲线表示E f f i c i e n t N e t V2原模型中引入的S E注意力模块的训练曲线;橙色㊁绿色曲线分别表示将E f f i c i e n t N e t V2模型中的S E替换为C B AM和E C A;紫色曲线为本文改进的引入C A注意力模块的训练曲线.将改进的E f f i c i e n t N e t V2模型称C A-E f f i c i e n t N e t V2模型.准确率的变化曲线能反应模型训练过程中对脑肿瘤的分类精度,准确率的值越高表示模型的分类正确率越高.损失值的变化曲线能反应模型训练过程中的优化结果,损失值越小表示模型的鲁棒性越好,当损失值趋于平稳时,表示模型训练达到了局部最优值.图6训练和验证的准确率和损失函数曲线F i g.6A c c u r a c y a n d l o s s f u n c t i o n c u r v e s f o r t r a i n i n g a n d v a l i d a t i o n由图6可见:在训练过程中4种模型的训练效果均较稳定,但C A-E f f i c i e n t N e t V2模型的精度明显高于其他3种模型,达到了98.9%,损失函数值明显低于其他3种模型,达到了0.022;在验证过程中,C A-E f f i c i e n t N e t V2模型的准确率有明显提升,训练曲线平稳且收敛效果好,达到了98.4%,其他3种模型训练过程中的振荡较严重,且准确率明显低于C A-E f f i c i e n t N e t V2模型;在损失函数值上,Copyright©博看网. All Rights Reserved.其他3种模型训练过程中的振荡极其严重,而C A -E f f i c i e n t N e t V 2模型的训练过程较稳定,虽有轻微振荡,但不影响实验结果,并且损失函数值低于其他模型.总体分析C A -E f f i c i e n t N e t V 2模型的训练曲线,由图6(A )和(B )可见,模型在前100轮保持稳定的上升趋势,在后100轮准确率保持稳定,说明模型得到了拟合.由图6(C )和(D )可见,模型在前40轮下降速度较快,在后面的轮数中下降趋于平缓,最后保持稳定,说明模型在训练过程中得到收敛.因此可证明C A -E f f i c i e n t N e t V 2模型对脑肿瘤有良好的分类效果.为更清楚地表达C A -E f f i c i e n t N e t V 2网络对每个类别的预测结果,也为更准确㊁更方便地计算评判模型的评价指标,本文给出了脑肿瘤图像数据集在该模型下预测结果的混淆矩阵,结果列于表3.在混淆矩阵中,从左上到右下的对角线表明每个类别正确预测的个数,对角线上的数量越多,说明模型对验证集数据的预测效果越好,以此进一步评估模型的性能.表3 预测结果的混淆矩阵T a b l e 3 C o n f u s i o nm a t r i x f o r p r e d i c t i o n r e s u l t s实际预测胶质瘤脑膜瘤垂体瘤胶质瘤11912脑膜瘤02940垂体瘤34190 由表3可见:122例脑膜瘤中只有3例被错误预测为垂体瘤;299例脑胶质瘤中有1例被错误预测为脑膜瘤,4例被错误预测为垂体瘤;192例垂体瘤中只有2例被错误预测为胶质瘤.为更直观地表达本文网络模型的分类效果,将脑膜瘤㊁胶质瘤㊁垂体瘤三类在P r e c i s i o n ,R e c a l l ,S p e c i f i c i t y ,F 1-S c o r e 评价指标上进行详细分析,结果列于表4.表4 本文网络模型的评价指标T a b l e 4 E v a l u a t i o n i n d e x e s o f p r o p o s e dn e t w o r km o d e l %类别P r e c i s i o n R e c a l l S p e c i f i c i t y F 1-S c o r e 胶质瘤97.597.599.497.5脑膜瘤98.3100.098.499.1垂体瘤99.096.499.597.7 经公式计算该模型在P r e c i s i o n ,R e c a l l ,S p e c i f i c i t y ,F 1-S c o r e4个评价指标上的均值达到98.3%,98.0%,99.1%,98.1%,进一步证明了改进的网络模型在脑肿瘤分类中的稳定性和鲁棒性.本文将C A -E f f i c i e n t N e t V 2网络模型与其他文献中使用的相同数据集的分类方法进行对比,对比结果列于表5.由表5可见:文献[6]使用传统机器学习的方法,采用灰度直方图㊁灰度共生矩阵(G L C M )和词袋模型(B OW )3种特征提取方法对脑肿瘤进行分类,该方法最终的分类准确率为91.28%;文献[26]采用G A N 网络作为鉴别器,用S o f t m a x 分类器代替最后一个全连接层,最终对脑肿瘤的分类准确率为93.01%;文献[27]采用多尺寸卷积核模块和多深度融合残差块相结合的方法,最终得到的脑肿瘤分类准确率为93.51%;本文方法得到的分类准确率达到98.4%.实验结果表明,本文方法对脑膜瘤㊁脑胶质瘤和垂体瘤3种脑部肿瘤有良好的分类效果.表5 不同方法的分类准确率对比T a b l e 5 C o m p a r i s o no f c l a s s i f i c a t i o na c c u r a c y o f d i f f e r e n tm e t h o d s 方法文献[6]文献[26]文献[27]本文分类准确性/%91.2893.0193.5198.403.4 消融实验与分析为更好地评估C A -E f f i c i e n t N e t V 2网络模型的性能,本文进行了消融实验.实验将分别验证引入坐标注意力模块和H a r d -S w i s h 激活函数这两个改进方法对模型准确率和损失率的影响.首先在原始数据集上进行测试,虽然模型在复杂程度上有所增加,但改进后的模型分类精确度有明显优势,在不同模块部分的消融对比结果列于表6.由表6可见:仅将S i L U 激活函数替换为H a r d -5711 第5期崔 博,等:基于改进E f f i c i e n t N e t V 2网络的脑肿瘤分类方法 Copyright ©博看网. 低温区易出现霜冻,不仅不利于烟苗出苗,而且影响烟叶采烤质量,因此需制作相应的低温冷害、霜冻专题气象服务产品,提前做好预报服务,及时建议,保障低温区烟叶采烤、烟苗出苗。
高温区制作相应的温度、日照时数、辐射强度、风速的实况观测、预报、预测服务材料,防止在晴天白天太阳辐射强时,拱棚内温度超过28℃。
少雨区自然降水不均衡、土壤保水能力差,旱情对烟草生产影响较为明显,烟苗移栽期前需做好干旱发生趋势预报,旱灾严重时,选择烟草抗旱品种种植,选择适当烟苗移栽时机,结合抗旱栽培技术研究,配合施肥的栽培技术,使烟草增产。
多雨区强降水、强对流天气多发,相应制作强降水、强对流及转折性天气预报,提供中短期大雨、暴雨、洪涝预报,强对流天气预报预警,重要天气过程预报服务。

In this way, we can ensure the emergence of tobacco seedlings in low-temperature area and the normal picking and baking of tobacco leaves. As for high-temperature area, the topic materials should contain information such as temperature, sunlight duration, radiation intensity, real-time wind speed, weather forecast, and climate prediction, which could prevent the temperatur e in the arch from exceeding 28˚C during the day when the solar radiation is strong. In rainless area, natural precipitation distribution is uneven, and soil water-holding capacity is poor. Therefore, drought has a more obvious impact on tobacco production. Before the transplanting period of tobacco seedlings, we need to predict the drought trend. When the drought situation is serious, we should choose drought-resistant tobacco varieties and appropriate timing to transplant tobacco seedlings. In addition, drought-resistant cultivation technology and suitable fertilizer application technology researches need to be strengthened to increase tobacco production. In rainy area, heavy precipitation and strong convective weather are frequent. 结果表明:随着再生粗骨料替代率的增加,混凝土的抗压及劈拉强度呈现先减小后增加再减小的变化趋势,拉压比大致呈现先减小后增加的变化趋势。
使用Design-Expert 软件对混凝土冻融损伤模型拟合参数a 及b 与再生粗骨料替代率之间的关系进行线性拟合,发现两者之间存在较好的相关性。
基于灰色系统理论GM(1,1)模型对混凝土的相对动弹性模量进行灰色系统理论分析,结果显示R0和R30模型精度评为Ⅱ级,其他组评为Ⅰ级;无论再生粗骨料替代率如何,DGM 的精度最大,ODGM 的精度最小;当再生粗骨料替代率大于50%后,再生粗骨料替代率对混凝土抗冻耐久性寿命影响较小。

The results show that with the increase of the replacement rate of recycled coarse aggregate, the compressive strength and splitting tensile strength of concrete show a trend of first decreasing,then increasing, and then decreasing, and the tension-compression ratio roughly shows a trend of first decreasing and then increasing. The relationship between the fitting parameters a and b of the concrete freeze-thaw damage model and the replacement rate of recycled coarse aggregate was linearly fitted using the Design-Expert software, and it was found that there was a good correlation between the two. These events may have serious consequences on crop production, so actions must be taken to minimize damaging effects. In particular, temperature predictions are of much help in frost protection decisions by providing the hortoculturist with warnings of critical temperatures. Consequently, reliable temperature prediction methods would be of significant economic value. These methods are usually empirical formulae based on significant correlations between the minimum temperature observed towards the end of the night and one or several meteorological variables measured at least several hours before this minimum is reached. These empirical regressions employ antecedent air temperature, various humidity measures, wind speed and cloud cover values. In this work we explore the possibility of developing an empirical prediction system for frost protection of fruits and vegetables in the southern part of the Santa Fe province in Argentina, in the region covered by the agrometeorological station located at Zavalla (33°01′S, 60°53′W). To this end we consider a handful of Machine Learning techniques usually employed in regression and classification problems, including Artificial Neural Networks, Simple Bayes classifiers and k-Nearest Neighbors. The results obtained in this preliminary study reveal a very noisy structure of the data that allows for only a slight improvement in performance of some of these more sophisticated nonlinear techniques over the standard (linear) multivariate regression equations.K EYWORDS: Frost Prediction, Machine Learning, Regression, ClassificationI NTRODUCTIONFrost is defined in the Glossary of Meteorology as the condition that exists when the temperature of the earth's surface and earthbound objects falls below freezing (0°C). These events are usually classified as advective or radiation frosts or as a combination of these two types [1]. Advective frosts develop during day or night as a result of a large-scale incursion of cold air, often from polar regions, and are characterized by moderate to strong winds and a well-mixed atmosphere. Radiation frosts occur at night and result from intense, longwave radiation cooling under calm, clear and dry atmospheric conditions. In this case the terrestrial radiation to space is relatively unimpeded because of the absence of clouds and heavy concentration of water vapor, and strong surface inversions develop in the stable atmosphere.Temperature is one of the primary factors influencing plant growth and its geographical distribution. In particular, frosts may have serious effects on crop production. The minimum temperature below which damage is caused varies with plant species and with growth stage for a given plant [2]. For advective frosts the temperature of the air mass may be well below 0°C and a large-scale protective action is often not feasible. These frosts are an agricultural problem only in high latitude regions and at high elevation elsewhere. Radiation frosts are particularly dangerous for agriculture and horticulture in regions between 15°S and 40°S and between 12°N and 40°N, where relatively infrequent short duration events may cause significant losses. Actions must be taken in the planning and operational stages of agriculture to minimize such damaging effects. A wide range of techniques is used in agriculture, and particularly in horticulture, to optimize the physical crop environment by altering the thermal regime of the air layer near the ground and by reducing long-wave radiation loss from soil and plants [1,2]. Heaters, burning solid, liquid or gaseous fuels, modify the crop environment by internal generation of heat. Wind machines consisting of large fans on towers produce a mixing of cold air within an orchard with the warmer air aloft. They change the sensible heat fluxes at the top of the box. The use of artificial fog is aimed at reducing the longwave radiation loss to the sky. Finally, irrigation with overhead sprinklers adds to the crop surface the fusion heat released from the freezing ice-water film on the plant surfaces. Sprinkler irrigation changes the latent and sensible heat transfer between the crop surface and the air in the box. It must be stressed, however, that most of these active methods for frost protection have significant energy requirements.Temperature predictions aid in frost protection decisions by providing the hortoculturist with warnings of critical temperatures. Besides the negative environmental impact, the high cost of heating oil and wind machine fuel, and the use of limited water resources are incentives to conserve these resources, and readily available temperature predictions may help to save hours worth of fuel or water consumption. Frost prediction methods have been reviewed by several authors (see, for instance, [3,4]). One usually distinguishes between empirical formulae and semi-empirical or theoretical expressions. Empirical formulae are generally proposed when a high correlation is observed between the minimum temperature observed towards the end of the night and one or several meteorological variables measured at least several hours before this minimum is reached. These empirical regressions employ antecedent air temperature, various humidity measures, wind speed and cloud cover values. These values are obtained at fixed times, often at sunset or at a time when the variables do not change too rapidly. Cellier[4] gives a useful summary of a wide range of empirical equations that employ similar variables. The differences between these equations indicate that many expressions have limited general applicability. In general, such empirical expressions may yield satisfactory results if they are used by competent meteorologists with a good knowledge of local conditions. On the other hand, semi-empirical/theoretical expressions result from a more orless simple analysis of the energy balance and heat transfer processes near the surface. In any case, reliable frost prediction methods to help in the decision-making problem of frost protection would be of significant economic value[5].In this work we aim to explore the possibility of developing an empirical prediction system for frost protection of fruits and vegetables in the southern part of the Santa Fe province in Argentina, in the region covered by the agrometeorological station located at Zavalla (33°01′S, 60°53′W). Further investigations of the problem should include both the use of the most recent data not available for this study and, most importantly, new predictor variables that could help extracting more accurate nonlinear information. This work is organized as follows. First, in Section 2 we present a brief time-series analysis of the data that will be useful to select suitable temperature predictors. Then, in Section 3 we describe the prediction methods used and in Section 4 we discuss the results obtained. Finally, in Section 5 we draw some conclusions.2. M INIMUM-T EMPERATURE T IME S ERIES A NALYSISIn order to remove seasonal variations in the minimum-temperature time series we obtained the mean annual wave using all the registers available (daily values between 1973 and 1989). Then, we fit this annual wave using a sinusoidal law, which is the behavior approximately followed by the solar irradiance, and finally subtracted it from the original data (see Fig. 1). To determine whether the residual series had a deterministic component or was purely stochastic in character, we generated 19 surrogates –that is, series with identical Fourier power spectrum but random phases–and tested the null hypothesis that the residual series is simply a linear and stationary Gaussian stochastic process [7]. To this end we used a discriminant statistics based in the prediction error of a nearest-neighbor predictor in pseudophase spaces of different dimensions. If this error were smaller for the original series than for the surrogates, then the hypothesis of a simple stochastic process can be rejected with a 95% level of confidence. However, in this case the prediction error for the original series was smaller than for the surrogates only for embedding dimensions D=2,3, loosing this property for larger D. Such behavior is observed for autocorrelated series, with persistence in their trends, so that it cannot be taken as a clear signature of determinism[8]. Consequently, we assumed that the minimum-temperature record corresponds to some stochastic process and sought for suitable predictor variables as described next.Besides the minimum-temperature times series, the daily records (taken at 8 p.m.) of four other surface variables (wet and dry bulb temperatures, cloud cover and wind intensity) were also available. Aiming to determine possible predictors, we studied the correlation between minimum temperatures and these surface variables. We finally selected all the variables having n-step correlations with minimum temperatures larger than 0.2, a threshold that optimized the performance of the prediction methods described in the next section. This criterion filtered the following prediction variables: wet and dry bulb temperatures and cloud cover at 8 p.m. of the previous day, and minimum temperatures of the two previous days (the deseasonalized temperature series retains a fairly large persistence, with a 2-step autocorrelation of approximately 0.35). Notice, however, that this analysis is based on linear correlations among the series; a more sophisticated analysis should use a nonlinear criterion based, for instance, on mutual information [9].T e m p e r a t u r e (oC )Day of the YearFig.1: Mean annual waves corresponding to minimum, wet bulb and dry bulb temperatures.The full lines are fits using sinusoidal laws.3. P REDICTION M ETHODSAs stated in the introduction, we will consider three different prediction methods to forecast the occurrence of frosts: Artificial Neural Networks (ANN), Simple Bayes (SB) classifiers and k -Nearest Neighbors (k-NN), using in all cases the same predictor variables selected in the previous section. Furthermore, we will attempt to forecast only whether at night the temperature will drop below 0ºC (frost) or not –a binary classification task– in two different ways: i) by predicting first the minimum temperature values –a standard regression problem– and then transforming the answer to a frost-no frost forecast, and ii) by facing the problem from the outset as a classification task. In the following we briefly describe the techniques used; a good introduction to these methods can be found in [6].ANN are computational architectures of significant importance in the analysis and prediction of time series[10]. In the last years they have been applied to many problems, including synthetic data from chaotic maps[11], real-world time series associated to atmospheric and climatological phenomena[12], economic indicators[13], etc. In our case we have first trained feedforward ANNhaving 5 input units (corresponding to the five predictor variables used), 1 output unit (for the temperature forecast), and alternatively 2 to 50 hidden units. After the networks learned the map predictor variables-minimum temperature, using the quadratic error as cost function in the learning process, the output was converted to a binary frost-no frost answer. In the next section we will present results corresponding to the 5:30:1 network, but the performance is only very slightly dependent on the number of hidden units. Alternatively, we trained ANN with softmax activation functions in the output units and cross-entropy cost function to tackle the problem directly as a classification task [6]. The results presented in this case correspond to networks with 2 hidden units. In the following we will identify the results corresponding to these two approaches by NR (for Neural Regressor) and NC (for Neural Classifier) respectively.SB (also called Naive Bayes) is a simple technique based on a probabilistic description of the data that is optimal for supervised learning if the attributes x=(x1,...,x d) used to classify patterns (predictor variables in our case) are independent. In such a case, the class-conditional probabilities factorizes, P(x|C)=∏i=1,d P(x i|C), and a simple fitting of P(x i|C) to a normal distribution in most cases produces very good results. Notwithstanding the fact that the independence condition is almost always violated, often the method remains competitive against more sophisticated techniques[14]. Here we will see that in spite of its simplicity SB is very competitive for this problem.In the k-NN method, an instance-based approach, one searches the database for k states of the system similar to the current one, and makes a temperature prediction using a suitable combination of the known outcomes corresponding to these similar situations. In our implementation we considered two different ways of finding the past states closest to the present one: i) the standard approach (S k, for Standard k-NN), in which the metric used to find the nearest neighbors weighs all the predictors equally, and ii) a variant in which we used a metric that weighs every predictor variable according to its correlation with the minimum-temperature time series. Since all records were previously normalized to a series with zero mean and standard deviation σ=1, this last procedure (called M k, for Modified k-NN) naturally introduces the consideration of the relative importance of different predictors. In this last case good results are obtained using k ~ 100 nearest-neighbor states. However, as we will discuss in the next section, the best results provided by this technique correspond to equal weighing of all predictors and an average over a very large number of neighbors (k ~ 1000), which essentially recovers standard multivariate regression results for this problem [15].In all cases we have used 2601 daily records of minimum temperatures and other surface variables corresponding to the period May-September of years 1973-1989. This record was randomly split in training and test sets, using 75% of the patterns for training and the remaining 25% to forecast frost occurrences. We kept the same ratio between number of frosts to total number of registers in both sets, which corresponds to 1951 records in the learning set –comprising 196 frost events– and 650 records with 65 frost events in the test set. Data were provided by the agrometeorological station located in Zavalla, Argentina (33º01′S, 60º53′W). The results obtained with the different methods above described are presented in the next section.4. R ESULTSFor the evaluation of results we considered the usual contingency table:from which one can define the following performance indices:Probability Of Detection:POD = a/(a+b)False Alarm Ratio: FAR =c/(a+c)Critical Success Index: CSI= a/(a+b+c)Percent Correct: PC = (a+d)/(a+b+c+d)Probability Of False Detection:POFD = c/(c+d)To evaluate the economic impact of protecting the cultivar on the basis of the frost forecasts, an economic measure like, for instance, E=αPOFD+β(1-POD), should be considered. Here the coefficients α and β represent, respectively, the cost of protecting the plants and the estimated crop loss due to failing to protect them in case of a frost. Of course, much more sophisticated models can be defined[5], including those that allow for changes in coefficients depending on the growth stage. In all cases, the prediction method should be selected as the one that minimizes E. Since we do not have reliable economic information available, in order to provide a simple measure in some of the tables below we quote the values of E for arbitrary coefficients α=1 and β=5.We have initially considered two possible scenarios: the first one corresponding to a strict frost prediction when the temperature is expected to drop below 0°C and the second one to an alarm indication when it is predicted to drop below 1°C. Tables I and II are, respectively, the contingency tables for these two cases, giving both separately the corresponding results for the learning and test sets. In addition, Tables III and IV present the values of the performance indices defined above. In all cases we have included the results obtained with the so-called Persistent Predictor (PP), which corresponds to asserting that tomorrow's minimum temperature will be equal to the one observed today. In spite of its simplicity, for largely autocorrelated series this predictor sets a stringent condition on the performance of successful learning methods and it is used here as a baseline. Notice also that the SB and NC methods have not been applied for the second scenario (alarm indication) due to their binary output (they do not regress temperature values as an intermediate step like the other methods).The analysis of the above tables indicates that all the classification methods considered largely improve on the persistent predictor. In particular, for the strict frost prediction SB has an edge over ANN and k-NN according to the POD index, although these two last methods produced substantially fewer false alarms (much smaller POFD). It is also interesting to note that setting the threshold for alarm indication T alarm=1°C leads to much better performances of ANN and k-NN though, as expected, this slightly deteriorates their POFD indices. The general improvement can beappraised from the combined index E, but this has to be taken with a grain of salt because of the arbitrary assumption made in defining this quantity.Table I: Contingency tables for the learning and test sets corresponding tothe different methods used, with an alarm threshold T alarm=0o C.Table II: Same as Table I but using T alarm=1o C.Table III: Performance indices for T alarm=0O C.Table IV: Same as Table III but with T alarm =1O CIn view of the above-discussed results, which point to an important role of the temperature threshold T alarm for regression methods, we have considered the ROC curves that can be constructed by varying this threshold (see Fig. 1). In practice, it is enough to move T alarm approximately in the range (-2,3)°C to obtain the whole curve in this figure. For the sake of comparison we also include the results for the Persistent Predictor (PP).To generate similar ROC curves for classification methods we considered the alternative of introducing a risk function, which modifies the relative importance of the more scarce but damaging frost events against the abundant no-frost pattern examples. For the SB classifier the implementation of this procedure is immediate since, according to the Bayes theorem, it is enough to rescale the class prior probabilities. Similarly, for the NC we chose to introduce in the cross-P O DPOFDentropy cost function a coefficient that multiplies the errors coming from undetected frost events, so that for large values of this coefficient the network will fit better these patterns than those corresponding to non-frost events. The ROC curves generated in this way are given in Fig. 3.Notice that the NC performance is given as scattered points that correspond to the results of different network training experiments; the observed dispersion is, however, not important.Fig. 3: ROC curve corresponding to the classification methods Neural Classifier (NC) and Simple Bayes (SB). C ONCLUSIONSWe have performed a preliminary study exploring the possibility of developing an empirical prediction system for frost protection of fruits and vegetables in the southern part of the Santa Fe province in Argentina. In this study we applied several Machine Learning techniques usually employed in regression and classification problems, including Artificial Neural Networks, Simple Bayes and k -Nearest Neighbors classifiers. The results obtained point to a very noisy structure of the data, which allows for only a slight improvement in the performance of some of these more sophisticated nonlinear techniques over the standard (linear) multivariate regression equations.Further investigations of the problem should include both the use of the most recent data not available for this study and, most importantly, new predictor variables that could help extractingP O DPOFDmore accurate nonlinear information. Another possibility, currently under investigations, is the modification of the training set for ANN by excluding obvious non-frost patterns, in order to allow the network to focus on the discrimination of close frost-no frost situations. This can be achieved, for instance, by considering the cloud cover and eliminating those days with extreme values that will not allow the occurrence of radiation frost. Notice that this could also be used to eliminate the few advective frosts included in the database, which can be predicted using different indicators. Finally, it could be interesting to consider ANN with a much larger number of hidden units, which would certainly overfit the training set. This can be exploited to build regression machines by ensembling diverse ANN predictors, thus reducing the error by maximizing the ensemble variance[16].A CKNOWLEDGEMENTSWe acknowledge M.A. Lara, O.
